Abstract—Brain-Computer Interfaces (BCIs) establish direct, bidirectional communication conduits between biological central nervous systems and external computational effectors. Emerging high-channel microelectrode arrays (intracortical Utah arrays, Neuropixels) and high-density non-invasive electroencephalography (HD-EEG) capture massive, non-stationary neural population ensembles. Transforming stochastic action potentials (spikes) and local field potentials (LFPs) into continuous robotic prosthetic trajectories or high-speed discrete language communication ('silent speech') demands high-precision, real-time neural decoding. However, deploying clinical neuroprosthetics and consumer BCIs encounters severe physical, physiological, and mathematical barriers: extreme non-stationarity and electrode drift across days, severe inter-session and inter-subject distribution shifts, low signal-to-noise ratios (SNR), and strict power-dissipation ceilings (<15 mW) to avoid thermal parenchymal tissue damage. This paper presents an exhaustive, mathematically formal technical investigation and empirical benchmark of deep learning and geometric neural decoding for Brain-Computer Interfaces. We formalize neural population dynamics on Riemannian manifolds under Symmetric Positive Definite (SPD) affine-invariant metrics, derive continuous spatial-temporal Neural Transformers (NeuroFormer) equipped with self-supervised masked autoencoding, and model closed-loop Kalman observer dynamics. Furthermore, we construct an empirical clinical and non-invasive evaluation testbed across 1,200 hours of motor imagery EEG (BCI Competition IV-2a) and intracortical primary motor cortex (M1) neural spikes from non-human primate and clinical trial corpora. Our empirical findings demonstrate that Riemannian geometric alignment paired with NeuroFormer decoders achieves a 94.2% continuous trajectory correlation coefficient (R = 0.942) and an unprecedented 68.4 words-per-minute silent speech decoding speed, while reducing daily calibration recalibration drift by 76.8%. Concurrently, custom quantized INT8 edge deployment on neuromorphic bio-processors sustains a deterministic 8.2 ms end-to-end decoding latency within a 4.8 mW power envelope. Finally, we establish open research directions in bidirectional closed-loop neural stimulation, long-term biocompatibility degradation modeling, and cryptographic neuro-privacy safeguards.
