The rapid advancement of artificial intelligence (AI) has increased the demand for reliable, efficient, and interpretable machine learning (ML) methods for complex prediction and decision-making tasks. However, conventional ML approaches often encounter challenges related to model optimization, generalization, computational efficiency, data imbalance, and limited interpretability. This study proposes an Advanced Machine Learning Framework for Algorithm Development, Optimization, and Explainable Intelligent Prediction that integrates data preprocessing, feature engineering, algorithm selection, Hyperparameter optimization, ensemble learning, and explainable artificial intelligence (XAI). Multiple ML algorithms, including Logistic Regression, Decision Tree, Random Forest, Support Vector Machine, K-Nearest Neighbors, Gradient Boosting, and Extreme Gradient Boosting, are comparatively evaluated. Model performance is assessed using accuracy, precision, recall, F1-score, area under the receiver operating characteristic curve (AUC-ROC), computational efficiency, and interpretability. Furthermore, SHAP and LIME techniques are incorporated to explain feature contributions and improve transparency in model predictions. The framework facilitates systematic comparison between conventional and optimized models while examining the trade-off between predictive performance, computational cost, and explainability. The proposed approach provides a generalizable pathway for developing robust and trustworthy intelligent prediction systems. Its applicability extends across healthcare, education, cyber security, finance, and other data-driven domains. The study contributes an integrated framework that combines algorithmic optimization with explainability to support accurate, transparent, efficient, and reliable ML-based decision-making systems.
